- Title: SculptDiff: Learning Robotic Clay Sculpting from Humans with Goal Conditioned Diffusion Policy
- Abstract summary: SculptDiff is a goal-conditioned diffusion-based imitation learning framework.
It works with point cloud state observations to learn clay sculpting policies for a variety of target shapes.
To the best of our knowledge this is the first real-world method that successfully learns manipulation policies for 3D deformable objects.

- Abstract: Manipulating deformable objects remains a challenge within robotics due to the difficulties of state estimation, long-horizon planning, and predicting how the object will deform given an interaction. These challenges are the most pronounced with 3D deformable objects. We propose SculptDiff, a goal-conditioned diffusion-based imitation learning framework that works with point cloud state observations to directly learn clay sculpting policies for a variety of target shapes. To the best of our knowledge this is the first real-world method that successfully learns manipulation policies for 3D deformable objects. State representation for materials that exhibit plastic behavior, like modeling clay or bread dough, is difficult because they permanently deform under stress and are constantly changing shape.
We propose a system that uses point clouds as the state representation and leverages pre-trained point cloud reconstruction Transformer to learn a latent dynamics model to predict material deformations given a grasp action.

Partial-View Point Clouds [7.1659268120093635]
Analytic models of elastic, 3D deformable objects require numerous parameters to describe the potentially infinite degrees of freedom present in determining the object's shape.
Previous attempts at performing 3D shape control rely on hand-crafted features to represent the object shape and require training of object-specific control models.
We overcome these issues through the use of our novel DeformerNet neural network architecture, which operates on a partial-view point cloud of the object being manipulated and a point cloud of the goal shape to learn a low-dimensional representation of the object shape.

Training computers to understand human grasping requires a rich dataset containing complex 3D object shapes, detailed contact information, hand pose and shape, and the 3D body motion over time.
We collect a new dataset, called GRAB, of whole-body grasps, containing full 3D shape and pose sequences of 10 subjects interacting with 51 everyday objects of varying shape and size.
This is a unique dataset, that goes well beyond existing ones for modeling and understanding how humans grasp and manipulate objects, how their full body is involved, and how interaction varies with the task.
